From my understanding, the exchanges will maintain few wallet addresses which hosts the coins of all customers. So, when we try to deposit any cryptocurrency into an exchange wallet, is the address that we see not unique to each user?

Depends on their implementation, on Bitcoin they generate a new keypair for each user
